Voice AI Implementation Guide
How to build voice-enabled AI applications, covering speech-to-text, text-to-speech, voice assistants, and real-time voice processing architectures.
Voice AI adds a natural language interface to applications through speech recognition (speech-to-text), speech synthesis (text-to-speech), and conversational understanding. Building voice AI involves coordinating multiple components with strict latency requirements - users expect voice interactions to feel conversational, which means end-to-end latency under two seconds.
Voice AI Architecture
A voice AI system has four core stages:
1. Speech-to-Text (STT). Convert the user’s spoken audio into text. This is the input stage.
2. Natural Language Understanding (NLU). Understand the intent and extract entities from the transcribed text. This may be handled by an LLM or a purpose-built NLU model.
3. Response Generation. Generate the appropriate response, either by retrieving information, performing an action, or generating text with an LLM.
4. Text-to-Speech (TTS). Convert the text response into spoken audio. This is the output stage.
Total latency is the sum of all four stages plus network overhead. Each stage must be optimized for speed.
Speech-to-Text Options
Cloud Services
Amazon Transcribe. Real-time and batch transcription. Supports 100+ languages. Custom vocabulary for domain-specific terms. Streaming API for real-time processing.
Google Cloud Speech-to-Text. Strong accuracy across languages. Real-time streaming support. Speaker diarization for multi-speaker scenarios.
Azure Speech Service. STT with real-time streaming. Strong custom model support. Integrated with Azure AI services.
Open Source
OpenAI Whisper. Excellent accuracy for transcription. Available in multiple sizes (tiny to large). Can be self-hosted for privacy. Not optimized for real-time streaming.
Faster-Whisper. Optimized implementation of Whisper using CTranslate2. Significantly faster than the original, making it more suitable for near-real-time applications.
Selection Criteria
For real-time voice applications, prioritize streaming support and latency. Amazon Transcribe Streaming and Google Cloud Speech Streaming both support real-time audio processing with results arriving in under 500ms.
For batch processing (transcribing recordings), prioritize accuracy. Whisper large models typically produce the highest accuracy but are slower.
For domain-specific vocabulary (medical, legal, technical), choose a service that supports custom vocabulary or custom model training.
Text-to-Speech Options
Cloud Services
Amazon Polly. Neural TTS with 60+ voices. SSML support for pronunciation and emphasis control. Low latency suitable for real-time applications.
Google Cloud TTS. 400+ voices across 50+ languages. Studio-quality neural voices. WaveNet and Neural2 voice options.
Azure Speech TTS. 400+ neural voices. Custom voice training for brand-specific voices. SSML support.
ElevenLabs. High-quality voices with strong expressiveness. Voice cloning capabilities. Higher cost but noticeably more natural-sounding output.
Considerations
Voice quality. Neural voices sound significantly more natural than standard voices. Always use neural voices for customer-facing applications.
Latency. TTS latency is critical for conversational applications. Use streaming TTS that begins playing audio before the full text is processed.
SSML support. Speech Synthesis Markup Language (SSML) allows controlling pronunciation, speed, pitch, and emphasis. Essential for natural-sounding output in specific contexts.
Real-Time Voice Architecture
For conversational voice AI (phone bots, voice assistants), the architecture must handle streaming audio in both directions:
Audio input stream. Audio from the user’s microphone or phone connection streams to the STT service continuously. The STT service returns partial transcriptions as the user speaks.
End-of-utterance detection. Detect when the user has finished speaking. This can be silence-based (pause detection) or model-based (detecting syntactic completion). Getting this right is critical for natural conversation flow.
Response generation. As soon as the user’s utterance is complete, send the transcription to the NLU and response generation components. Optimize for first-token latency.
Audio output stream. Stream the TTS audio back to the user. Begin playback as soon as the first audio chunk is available, before the full response is generated.
Interrupt handling. Users may speak while the system is responding (barge-in). Detect this and stop playback, process the new input, and respond accordingly.
Latency Optimization
Target: under 2 seconds from end of user speech to beginning of system response.
Parallelize where possible. Start NLU processing on partial transcriptions before the user finishes speaking. Begin TTS on the first sentence of the response while generating subsequent sentences.
Use streaming APIs. Streaming STT and TTS reduce latency by avoiding the overhead of waiting for complete input or output.
Cache common responses. For frequently asked questions, pre-generate and cache the TTS audio. Serve cached audio with minimal latency.
Optimize model selection. Use the fastest models that meet quality requirements. A smaller, faster LLM may be preferable to a larger, more capable one for real-time voice applications.
Edge processing. For the most latency-sensitive applications, run STT and TTS on edge devices close to the user. This eliminates network round-trip latency for audio processing.
Phone Integration
Voice AI over phone systems requires additional considerations:
Telephony integration. Use SIP trunking to connect to phone networks. Services like Amazon Connect, Twilio, and Vonage provide telephony infrastructure that integrates with AI components.
Audio quality. Phone audio is typically 8kHz narrowband, lower quality than microphone audio. Ensure your STT model handles narrowband audio well. Amazon Transcribe and Whisper handle this natively.
DTMF handling. Some interactions require touch-tone input (enter your account number). Handle DTMF alongside voice input.
Call recording and compliance. Record calls for quality assurance and compliance. Implement proper consent mechanisms per jurisdiction.
Testing Voice AI
Transcription accuracy testing. Build a test set of audio clips with known transcriptions. Measure word error rate (WER) across different accents, background noise levels, and audio quality.
End-to-end testing. Test the full voice flow: speak a request, verify the transcription, check the response content, and evaluate the TTS output quality.
Noise robustness. Test with background noise (office environments, cars, crowds). Voice AI that only works in quiet rooms is not useful.
Accent and dialect coverage. Test with speakers representing the expected user population. Many STT systems perform worse on non-standard accents.
Voice AI is technically complex but produces highly natural user experiences when done well. Start with a simple use case (FAQ answering over voice), optimize the latency, and expand capabilities incrementally.
